Genetic Algorithm

Evolutionary Learning

 Evolutionary learning is a type of machine learning that uses evolution-inspired


algorithms to solve optimization problems.
 It works like natural selection—random solutions are generated, tested, and ranked
based on their performance (fitness function).
 The best solutions are selected, combined, and evolved over multiple iterations until
an optimal or near-optimal solution is found.

Genetic Algorithm (GA)

 Genetic Algorithm is a computerized version of evolution, where solutions evolve


by modifying parent genes to create better offspring.
 To implement GA in a computer, we need:
o A way to represent the problem as chromosomes (solution encoding).
o A fitness function to evaluate solutions.
o A selection process to pick the best parents.
o A method to generate new offspring by combining parent solutions.
 Example: Instead of using a greedy method for the Knapsack Problem, GA can be
used to find a better solution through evolution.

String Representation in Genetic Algorithms

String representation (or chromosome encoding) is how we represent possible solutions in a


genetic algorithm. This is important because it affects how genetic operations like crossover
and mutation work.

Types of String Representations:

1️. Binary Representation

 What it is: Solutions are represented as binary strings (0s and 1s).
 Example: 10101011
 Used for: Problems naturally expressed in binary, like combinatorial problems.

2️. Integer Representation

 What it is: Solutions are sequences of integers.


 Example: 5 3 8 2 7
 Used for: Scheduling, routing, and other sequence-based problems.

3️. Real-Valued Representation


 What it is: Solutions are represented as real numbers (decimals).
 Example: 3.14 2.71 1.41 0.577
 Used for: Optimization problems in continuous search spaces, like function
optimization.

4️. Permutation Representation

 What it is: Solutions are represented as permutations (ordered sequences).


 Example: 4 1 3 2 5
 Used for: Problems where order matters, like the Traveling Salesman Problem or
job scheduling.

Evaluating Fitness in Genetic Algorithms

Evaluating fitness is a key step in genetic algorithms to measure how well each solution
performs for a given problem.

Steps to Evaluate Fitness

1. Define the Fitness Function


o The fitness function is a mathematical formula that measures how good a
solution is.
o Example: In the Traveling Salesman Problem, the fitness function can be 1 /
total travel distance (shorter distances get higher fitness scores).
2. Apply the Fitness Function
o Each solution in the population is tested using the fitness function to get a
fitness score.
o Example: In a business optimization problem, solutions (strategies) are
evaluated based on profitability.
3. Normalization (Optional)
o Normalization helps control large variations in fitness values, improving the
selection process.
o Example: Scaling fitness values between 0 and 1 for consistency.
4. Selection for Reproduction
o The best individuals are chosen as parents to create the next generation.
o Common selection methods:
 Roulette Wheel Selection – Higher fitness means higher selection
probability.
 Tournament Selection – Randomly pick a group and select the best
among them.
 Rank Selection – Rank individuals by fitness and assign selection
probabilities based on rank.
Population in Genetic Algorithms

The population is the collection of all potential solutions to the problem.

Role of the Population:

 Diversity: A diverse population explores different solutions, reducing the risk of


getting stuck in bad solutions (local optima).
 Evolution: Over generations, better solutions emerge as fitter individuals pass their
traits to offspring.
 Selection: Fitness evaluation ensures that stronger solutions are more likely to be
selected, leading to improved overall performance.

Generating Offspring: Parent Selection in Genetic Algorithms

Parent selection is a crucial step in genetic algorithms to ensure that the population evolves
toward better solutions. Different selection methods determine how individuals are chosen for
reproduction.

Parent Selection Methods

1. Roulette Wheel Selection (Fitness Proportionate Selection)


o How it works: Each individual gets a selection probability proportional to its
fitness, like sections on a roulette wheel. Higher fitness means a bigger
section.
o Advantages: Simple to implement, gives higher chances to fitter individuals.
o Disadvantages: Slow convergence if fitness differences are small.
2. Tournament Selection
o How it works: Randomly pick a group (tournament) from the population and
select the fittest individual. Tournament size can be adjusted.
o Advantages: Easy to use, allows tuning by changing tournament size.
o Disadvantages: Larger tournaments reduce genetic diversity.
3. Rank Selection
o How it works: Individuals are ranked by fitness, and selection probabilities
are assigned based on their rank rather than absolute fitness values.
o Advantages: Prevents premature convergence, ensures even weaker
individuals have a chance.
o Disadvantages: Sorting the population adds computational cost.
4. Stochastic Universal Sampling (SUS)
o How it works: Similar to the roulette wheel, but selects multiple individuals
at evenly spaced intervals to ensure a balanced selection.
o Advantages: Ensures a more uniform spread of selected individuals.
o Disadvantages: More complex to implement than standard roulette selection.
5. Truncation Selection
o How it works: Selects the top percentage of the fittest individuals.
o Advantages: Simple and easy to apply.
o Disadvantages: Can reduce genetic diversity, leading to early convergence.

Genetic Operators in Genetic Algorithms

Genetic operators drive the evolutionary process by modifying individuals in the population
to improve their fitness. The main genetic operators are:

1. Selection

 Purpose: Chooses individuals to act as parents for the next generation.


 Common Methods:
o Roulette Wheel Selection: Higher fitness = Higher chance of selection.
o Tournament Selection: Selects the best from a randomly chosen group.
o Rank Selection: Selection probability is based on ranking rather than absolute
fitness.

2. Crossover (Recombination)

 Purpose: Combines genetic material from two parents to create new offspring,
introducing new genetic structures.
 Types of Crossover:
o Single-point Crossover: Swaps segments after a single chosen point.
o Multi-point Crossover: Swaps segments between two or more points.
o Uniform Crossover: Each gene is randomly taken from either parent.

3. Mutation
 Purpose: Introduces random changes to maintain genetic diversity and prevent
premature convergence.
 Types of Mutation:
o Bit Flip Mutation: Inverts a bit in a binary string.
o Swap Mutation: Swaps two genes in the chromosome.
o Gaussian Mutation: Adds a small random value to real-valued genes.

Example:
Before Mutation: 10101010

 Mutate 3rd bit → 10001010


 Mutate 7th bit → 10001000
After Mutation: 10001000

4. Replacement

 Purpose: Determines how new offspring replace individuals in the population.


 Replacement Strategies:
o Generational Replacement: The entire population is replaced by offspring.
o Steady-State Replacement: Only a few individuals are replaced per iteration.

Elitism

 Purpose: Ensures the best individuals are carried over unchanged to the next
generation, preventing the loss of high-quality solutions.
 Implementation: A fixed number of top individuals (elites) are copied directly to the
next generation.
 Benefit: Increases the chance of reaching the global optimum.

Niching

Niching helps maintain diversity by forming subpopulations around different optimal


solutions, useful for multi-modal optimization problems.

Methods of Niching:

 Fitness Sharing: Lowers the fitness of similar individuals to spread the population.
 Crowding: Limits the replacement of similar individuals to maintain diversity.
 Clearing: Limits the number of individuals per niche to control dominance.

Benefits of Niching:

 Encourages exploration of multiple solutions.


 Prevents premature convergence to a single solution.
Challenges: Complex to implement and requires fine-tuning.

Basic Genetic Algorithm (GA) Steps

1. Initialization
o Generate a random population of potential solutions
(chromosomes/individuals).
2. Fitness Evaluation
o Use a fitness function to measure how well each individual solves the
problem.
3. Selection
o Choose individuals based on fitness to act as parents (e.g., Roulette Wheel or
Tournament Selection).
4. Crossover (Recombination)
o Combine genetic material from parents to create new offspring.
5. Mutation
o Introduce small random changes to maintain diversity and explore new
solutions.
6. Replacement
o Replace some or all individuals in the population with new offspring.
7. Iteration
o Repeat the process until a stopping condition is met (e.g., a set number of
generations or an optimal solution is found).

Using Genetic Algorithms in Real Problems

1. Map Coloring

 Goal: Assign colors to different regions of a map using a limited number of colors.
 Constraint: No two adjacent regions should have the same color.
 GA helps find an optimal coloring while exploring different possibilities.

2. Punctuated Equilibrium in GA

 Concept: Long periods of slow improvement are followed by sudden breakthroughs.


 Application: Genetic algorithms may show little progress for many generations, then
suddenly improve due to key mutations or crossovers.
3. Knapsack Problem

 Goal: Select a combination of items to maximize total value without exceeding weight
limits.
 GA finds near-optimal solutions by evolving different selections over time.

4. Four Peaks Problem

 A benchmark problem used to test optimization algorithms.


 The challenge: Finding the best global solutions in a landscape with two local optima
and two global optima.
 GA is effective as it avoids getting stuck in local optima and finds the best overall
solution.

Limitations of Genetic Algorithms (GA)

1. Computational Complexity
o High Computational Cost: GAs can be expensive in terms of processing
power, especially for large populations and complex problems.
o Slow Convergence: Finding an optimal or near-optimal solution can take a
long time due to repeated iterations.
2. Premature Convergence
o Local Optima: GAs may get stuck in suboptimal solutions if the population
loses diversity too soon.
o Genetic Drift: Random errors can reduce genetic diversity, weakening the
algorithm's performance over generations.
3. Parameter Sensitivity
o Tuning Required: Performance depends on carefully chosen parameters
(population size, mutation rate, crossover rate).
o No Universal Settings: Different problems require different parameter
settings, making tuning challenging.
4. Representation Issues
o Encoding Problems: Choosing the right representation (binary, integer, real-
valued) affects performance.
o Complex Solutions: Some problems have intricate solution spaces that are
hard to encode efficiently.
5. Fitness Function Challenges
o Fitness Calculation: Evaluating solutions can be computationally expensive.
o Design Complexity: Creating an effective fitness function that aligns with the
problem’s goals can be difficult.
6. Scalability
o Large-Scale Problems: GA performance drops for massive problems due to
exponential growth in search space.
o Parallel Processing Needed: Large populations require parallel processing,
which adds complexity.
7. Randomness
o Stochastic Nature: GAs rely on random processes, leading to inconsistent
results across runs.
o Unpredictability: The algorithm might fail to find a good solution within a
reasonable time frame.
